English

This study proposes an adaptive end-to-end transformer-based deep learning model for carbon price forecasting, integrating spatio-temporal attention, a self-decomposition mechanism, and Particle Swarm Optimization for hyperparameter tuning. Tested on China's ETS data (Hubei, Guangdong, Beijing), it achieves the lowest daily MAPE of 3.26%, 3.71%, and 4.83%, outperforming state-of-the-art models in one-step and multi-step forecasting. Improved carbon price prediction offers practical insights for production, operations, and investment decisions.

📄 Abstract(原文)

Carbon price forecasting is crucial for carbon emission trading in mitigating global warming, providing practical insights for decision-making in production, operations, and investments. However, modeling the non-stationary and nonlinear nature of carbon pricing poses a formidable challenge for conventional statistical approaches, necessitating sophisticated artificial feature engineering within the framework of machine learning. To address these challenges, this study introduces an adaptive end-to-end transformer-based deep learning model for accurately predicting carbon prices. The proposed method incorporates three innovative elements to enhance feature extraction ability and training robustness: (1) the spatio-temporal attention mechanism, capturing both time-dependent and time-independent features; (2) the self-decomposition mechanism, enabling adaptive and effective preprocessing; (3) the utilization of the Particle Swarm Optimization algorithm for hyperparameter optimization. Empirical analysis using carbon price data from China’s Emissions Trading System (ETS) demonstrates that the proposed method outperforms state-of-the-art forecasting models in both one-step-ahead and multi-step-ahead prediction scenarios. It achieves the lowest Mean Absolute Percentage Error (MAPE) of 3.26%, 3.71%, and 4.83% in daily forecasting for Hubei, Guangdong, and Beijing ETS, respectively.
