English

This paper proposes a multi-factor attention-based deep learning framework that integrates economic indicators, energy commodity prices, and policy signals to forecast carbon market prices. Experiments on China's regional carbon markets and the EU ETS show superior RMSE, MAE, and R² compared to traditional statistical and mainstream deep learning models. Attention analysis reveals the dynamic importance of drivers under varying market conditions, supporting market design, risk management, and algorithmic trading.

📄 Abstract(原文)

To address the challenges of high volatility and complex multi-factor interactions in carbon market price forecasting, this paper proposes a novel deep learning framework based on multi-factor attention mechanisms for comprehensive fluctuation analysis and accurate prediction. The proposed approach integrates heterogeneous factors—including economic indicators, energy commodity prices, and macro-level policy signals—and employs a dynamic attention mechanism to adaptively adjust the influence weights of each factor over time. This enables the model to precisely capture the dominant market drivers and their temporal evolution. Extensive experiments on large-scale historical datasets from China’s regional carbon markets and the EU Emissions Trading System (EU ETS) demonstrate that the proposed method consistently outperforms traditional statistical models and mainstream deep learning baselines in terms of root mean square error (RMSE), mean absolute error (MAE), and coefficient of determination (R²). Furthermore, attention-based feature analysis reveals the dynamic importance of different drivers under varying market conditions, providing scientific support for market design, risk management, and algorithmic trading. This study not only enhances the interpretability and robustness of carbon price fluctuation analysis and prediction, but also lays a solid methodological and data-driven foundation for climate policy evaluation and carbon finance innovation.
